Case Study 2: StreamFlow Churn Rate Forecasting with Prophet
Background
StreamFlow's finance team needs to forecast the monthly churn rate for the next 6 months. This is not an academic exercise --- the forecast drives three concrete business decisions:

Retention budget allocation. StreamFlow spends $2.1M/month on retention campaigns. If churn is projected to spike, the budget increases. If churn is stable or declining, the budget can be redirected to acquisition.

Revenue planning. StreamFlow has 2.4M subscribers at $15/month average revenue per user (ARPU). A 1 percentage point change in monthly churn rate translates to 24,000 subscribers, or $360K/month in revenue. Six-month projections drive the quarterly earnings guidance.

Headcount planning. The customer success team scales with churn. A sustained increase in churn means hiring more retention specialists. A sustained decrease means reallocating headcount to growth.
The data science team has been asked to deliver a monthly churn rate forecast with uncertainty bounds. The VP of Finance explicitly asked: "Don't just give me a number. Give me a range, and tell me how bad it could get."
The Data
StreamFlow has tracked monthly subscriber counts and churn since January 2020. That gives us 4 years of history --- 48 months --- with enough data to capture annual seasonality patterns.

Key observations from the plots:

Downward trend in churn: The baseline has improved from ~8.2% to ~6.8% over 4 years. Product improvements, a better onboarding flow, and retention campaigns are working.

Seasonal pattern: Churn is highest in January (post-holiday account cleanup) and lowest in October-November (leading into the holiday season).

Discrete events: Three visible disruptions --- the COVID-19 lockdown (lower churn), the July 2022 price increase (churn spike), and the March 2023 competitor launch (moderate churn increase). These are the events that make churn forecasting harder than it looks.

The seasonal naive baseline (predict what happened 12 months ago) gives 9.4% MAPE. Any model we build must beat this. If it cannot, the model is not adding value over a simple heuristic.
Phase 3: Prophet Model
Prophet is the natural choice for this problem: monthly data with annual seasonality, known events (price increase, competitor launch), and a non-technical end user (VP of Finance) who needs interpretable components.

The component analysis tells a clear story:
- Trend: Churn improved by 1.27 percentage points over 42 months. That is real and sustained improvement.
- Seasonality: There is a 1.8 percentage point swing between the highest-churn month (January) and the lowest-churn month (October/November). This is a predictable, recurring pattern.
- Events: The price increase temporarily added 1.6 points to churn. COVID temporarily reduced churn by 1.8 points. These are one-time effects that the model accounts for but does not project into the future (unless explicitly told about upcoming events).
Phase 5: Walk-Forward Validation with Prophet
The 6-month hold-out test is useful but limited --- it is a single evaluation window. Walk-forward validation gives us a more robust estimate of forecast reliability.

The degradation pattern is clear and expected: 1-month forecasts have 4.2% MAPE, but 6-month forecasts have 9.5% MAPE. This is essential context for the VP of Finance --- the January forecast is much more reliable than the June forecast.

The model estimates a price increase would add 1.3-1.6 percentage points to churn for 3 months, based on the pattern from the 2022 price increase. At 2.4M subscribers, that translates to an additional 31,000-38,000 churned subscribers per month during the impact window --- approximately $5.7M in lost revenue over 3 months. This gives the finance team a concrete cost estimate to weigh against the revenue gain from the price increase.
