The Override Problem

Athena Retail Group's demand forecasting model has been in production for six months. By every technical metric, it is a success. Accuracy sits at 82 percent across product categories. Mean absolute error has improved by 31 percent compared to the legacy spreadsheet-based forecasting method. The engineering team that built it — drawing on the regression techniques from Chapter 8 and the time-series methods from Chapter 16 — considers it one of their finest deployments.

There is just one problem. Nobody is using it.

Ravi Mehta opens Tuesday's guest lecture with a single slide. On it, two numbers:

Override rate: 68%

Model accuracy: 82% | Manager accuracy: 71%

"Thirty-four out of fifty regional managers," Ravi says, "are overriding the model's demand forecasts and substituting their own judgment. They are doing this consistently, across product categories, across regions. The model is right 82 percent of the time. The managers, when they override, are right 71 percent of the time."

He lets the numbers sit.

"In dollar terms, the overrides are costing Athena approximately $2.8 million per quarter in excess inventory and stockouts. That is $11.2 million annually — more than three times what we spent building the model."

Tom Kowalski, who helped architect the model's evaluation framework during his Athena internship, stares at the slide with the particular frustration of an engineer whose code works perfectly and whose users refuse to cooperate.

"Did you mandate compliance?" Tom asks. "If the model is objectively better, why not just... require them to use it?"

Ravi shakes his head slowly. "That was my first instinct. My COO's first instinct. My CEO's first instinct. We came very close to sending a directive: effective immediately, all demand forecasting decisions will follow the model's recommendations unless a regional manager submits a written override request with justification."

"Why didn't you?"

"Because I talked to the regional managers first. I asked them a simple question: Why don't you trust it?"

He clicks to the next slide. Six quotes from regional managers, anonymized:

  • "It doesn't know that we just lost our best associate in the housewares department."
  • "It recommended increasing inventory on winter coats in October. In Phoenix."
  • "I've been doing this for sixteen years. No algorithm understands my market like I do."
  • "They never explained how it works. Just told us to follow the numbers."
  • "Last quarter it recommended cutting back on school supplies. School starts two weeks early in our district."
  • "My bonus is tied to inventory performance. I'm not risking my compensation on a black box."

NK Adeyemi reads the quotes carefully. She has been preparing to launch her personalization engine for Athena's loyalty program — the project she developed across Chapters 24 and 33. The store managers who are overriding the demand model are the same people she will need to adopt her personalization recommendations.

"Two of these are data problems," NK says. "The Phoenix one and the school calendar one — those sound like the model needs local features it doesn't have. But the rest..." She pauses. "The rest are people problems."

"Correct," Professor Okonkwo says. "And this is the most expensive paragraph in the book. The technology worked. The change management failed. The project failed."

She steps to the whiteboard and writes:

"This chapter is about the right side of that equation. We will spend it learning how to manage the organizational change that AI requires — not because change management is a 'soft' discipline that supplements the 'real' work of building models, but because it is the work. Without adoption, accuracy is irrelevant."


35.1 Why AI Needs Change Management

Let us begin with a question that has an obvious answer — and a deeper one.

Why does AI require change management?

The obvious answer: because AI changes how people work, and people resist change. This is true but insufficient. AI requires change management for the same reason that any major organizational transformation does — because it disrupts established workflows, challenges existing expertise, shifts power dynamics, and introduces uncertainty about the future. What makes AI different from previous technology transformations is not the general principle but the specific ways in which it disrupts.

How AI Differs from Previous Technology Waves

Every generation of business technology — from mainframes to PCs to the internet to mobile — required organizational adaptation. But AI differs in four critical respects:

Definition: Change management is the structured approach to transitioning individuals, teams, and organizations from a current state to a desired future state. In the AI context, it encompasses the strategies, processes, and tools used to help employees adopt AI-powered workflows, trust algorithmic recommendations, and integrate human-machine collaboration into daily work.

1. AI replaces judgment, not just tasks. Previous technologies automated manual tasks: data entry, calculation, document formatting. AI automates decisions — which products to stock, which customers to target, which candidates to interview. When technology automates a task, employees learn a new tool. When technology automates a judgment, employees face an existential question: What is my role now?

2. AI is probabilistic, not deterministic. An ERP system produces the same output every time you enter the same input. An AI model produces recommendations with confidence scores, prediction intervals, and error rates. Managers accustomed to definitive answers must learn to work with probabilities — and that is a cognitive shift, not just a technical one.

3. AI is opaque in ways that previous technologies were not. A spreadsheet formula can be audited cell by cell. A deep learning model with millions of parameters cannot be inspected with the same transparency. This opacity creates a trust deficit that must be actively managed. As we explored in Chapter 26, explainability is not just a technical feature — it is a prerequisite for adoption.

4. AI triggers identity-level concerns. No one's professional identity was threatened by the introduction of email. AI threatens professional identities. The store manager who prides herself on "knowing her customers" feels diminished when an algorithm claims to know them better. The radiologist who has spent twenty years developing diagnostic expertise watches an AI system match that expertise in months. The threat is not just economic — it is personal.

Research Note: A 2024 study published in Organizational Science surveyed 2,400 professionals across industries and found that "identity threat" — the perception that AI diminishes the value of one's professional expertise — was a stronger predictor of AI resistance than economic anxiety (fear of job loss). Professionals who felt their expertise was being devalued were 3.2 times more likely to actively resist AI adoption, even when they acknowledged the technology's accuracy.

The McKinsey Ratio

In Chapter 1, we cited McKinsey's finding that for every dollar companies spend on AI technology, they need to spend three to five dollars on change management, training, and process redesign. By Chapter 35, we can sharpen this ratio with specifics:

Tom studies this table for a long moment. "You're telling me that building the model — the part I thought was the job — is 20 to 30 percent of the investment?"

"At most," Ravi confirms. "I tell every new data scientist I hire: your model is 20 percent of the work. Getting people to use it is the other 80."

Business Insight: The distinction between "deploying a model" and "deploying a change" is the most important conceptual shift in this chapter. MLOps (Chapter 12) ensures the model runs in production. Change management ensures the model runs in practice — that is, that real people in real workflows actually use it to make better decisions.


35.2 The ADKAR Model Applied to AI

Among the most widely used change management frameworks in business is ADKAR, developed by Prosci founder Jeff Hiatt. ADKAR is an acronym for five sequential outcomes that individuals must achieve for change to succeed:

  1. Awareness of the need for change
  2. Desire to participate and support the change
  3. Knowledge of how to change
  4. Ability to implement required skills and behaviors
  5. Reinforcement to sustain the change

Definition: The ADKAR model is an individual-focused change management framework that identifies five sequential building blocks — Awareness, Desire, Knowledge, Ability, and Reinforcement — each of which must be achieved before the next can succeed. It is particularly useful for diagnosing where in the change process adoption is breaking down.

The power of ADKAR is diagnostic. When a change initiative stalls, ADKAR helps you identify the specific bottleneck. Are people unaware of why the change is happening? Do they know but not care? Do they care but lack the skills? Do they have the skills but cannot apply them in practice? Did they adopt the change but then revert?

Let us apply ADKAR to Athena's demand forecasting override problem.

A — Awareness

Question: Do regional managers understand why Athena is implementing AI-powered demand forecasting?

Athena's Reality: Ravi's investigation revealed that most regional managers understood that the model existed but not why it was introduced. The rollout communication consisted of a two-paragraph email from the COO announcing the new system, a 30-minute webinar demonstrating the interface, and a FAQ document posted on the intranet. None of these communications explained the business case — the inventory waste, the stockout costs, the competitive pressure from NovaMart that was driving the investment.

Diagnosis: The awareness gap was not about the technology's existence but about its strategic rationale. Managers knew they had a new tool. They did not know why the old way was insufficient.

D — Desire

Question: Do regional managers want to use the model?

Athena's Reality: Even managers who understood the rationale had no personal incentive to adopt it. Their compensation was tied to inventory performance — but the formula used historical metrics that rewarded intuition-based decisions. Managers who followed the model and got it wrong would be penalized. Managers who followed their own judgment and got it wrong could at least point to their experience as justification. The risk calculus was asymmetric: the model's upside was shared (better company-wide inventory), while the downside was personal (individual performance reviews).

Diagnosis: The incentive structure actively discouraged adoption. Desire cannot be manufactured through inspiration alone; it must be supported by aligned incentives.

K — Knowledge

Question: Do regional managers know how to use the model effectively?

Athena's Reality: The 30-minute webinar demonstrated which buttons to click but did not teach managers how to interpret the model's outputs — confidence intervals, demand curves, seasonal adjustment factors. Managers received a number (recommended order quantity) but did not understand how that number was derived or what assumptions it rested on. Without this knowledge, the model was a black box issuing orders, not a tool supporting decisions.

Diagnosis: Training focused on the interface, not the methodology. Managers needed to understand not just what the model recommended but why — and under what conditions it was likely to be wrong.

A — Ability

Question: Can managers incorporate the model into their actual workflow?

Athena's Reality: The demand forecasting model existed in a separate dashboard from the inventory management system. Using the model required managers to log into a different application, navigate to their region, export the recommendations, and manually enter them into the ordering system. This added approximately 25 minutes to a process that previously took 15 minutes. The model was not integrated into the workflow; it was bolted on top of it.

Diagnosis: Even willing managers faced a friction barrier. The operational integration was incomplete, making adoption effortful rather than seamless.

R — Reinforcement

Question: Is sustained adoption recognized and rewarded?

Athena's Reality: No mechanism existed to track individual adoption, celebrate early successes, or share stories of the model's value. The few managers who did use the model and saw improved results had no venue to share those results with peers. Meanwhile, managers who overrode the model faced no consequence — reinforcing the behavior.

Diagnosis: Without reinforcement, even initial adoption decays. Change that is not celebrated and sustained will regress.

Athena Update: Armed with this ADKAR diagnosis, Ravi redesigned Athena's adoption strategy. He addressed each gap systematically: town halls explaining the business rationale (Awareness), revised compensation formulas that rewarded model-informed decisions (Desire), a redesigned training program covering model methodology (Knowledge), API integration between the forecasting dashboard and the ordering system (Ability), and monthly "accuracy scorecards" that publicly compared model vs. manager performance — with recognition for the top-performing human-AI teams (Reinforcement). The results, six months later: override rate dropped from 68% to 22%. We will return to these results later in the chapter.


35.3 Kotter's 8-Step Model for AI Transformation

While ADKAR focuses on individual adoption, John Kotter's 8-step change model addresses organizational transformation at the leadership level. Originally published in Kotter's 1996 book Leading Change and updated in subsequent editions, the framework describes a sequence of organizational actions required for large-scale change to succeed.

Let us examine each step through the lens of AI transformation.

Step 1: Create a Sense of Urgency

Kotter's first step requires leaders to help stakeholders understand why the change cannot wait. For AI initiatives, urgency typically comes from three sources:

  • Competitive threat. A competitor's AI deployment that threatens market position. At Athena, NovaMart's AI-powered shopping experience (which we will examine in Chapter 37) created urgency that internal arguments could not.
  • Operational pain. Quantified costs of the status quo — the $11.2 million annual cost of demand forecasting overrides, for instance.
  • Regulatory mandate. Requirements that cannot be met without AI capabilities — such as real-time fraud detection in financial services or adverse event monitoring in pharmaceuticals.

Caution

Urgency is not the same as panic. Leaders who frame AI as "adopt or die" often trigger fear-based resistance rather than constructive engagement. The goal is to create a compelling case for change, not to weaponize anxiety.

Step 2: Build a Guiding Coalition

No AI transformation succeeds from the top down or the bottom up alone. It requires a coalition of influential stakeholders who span the organization:

  • Executive sponsor. A C-suite leader with budget authority and political capital. At Athena, this is the CEO, Grace Chen, with Ravi as the operational leader.
  • Technical champions. Data scientists and engineers who can translate AI capability into business language. Tom Kowalski fills this role during his Athena engagement.
  • Business champions. Department leaders who see AI's value for their function. NK Adeyemi, who is building the personalization engine, serves as the marketing champion.
  • Frontline influencers. Respected employees at the operational level whose adoption signals to peers that the change is legitimate. At Athena, Ravi identified three regional managers with strong peer networks and invited them to participate in the model's validation — turning potential resisters into advocates.
  • HR and L&D partners. Learning and development specialists who design and deliver training programs.

Business Insight: The most common mistake in building an AI coalition is making it entirely technical. If the guiding coalition consists only of data scientists and engineers, the initiative will be perceived as a technology project, not a business transformation. Conversely, a coalition with no technical depth cannot make credible decisions about model limitations and tradeoffs.

Step 3: Develop a Vision and Strategy

The vision for AI transformation must answer a deceptively simple question: What does our organization look like when AI is embedded in how we work?

Ravi's vision for Athena, developed with the guiding coalition, was articulated in a single paragraph:

"Athena becomes an organization where every significant business decision is informed — not dictated — by data and AI. Our people remain the decision-makers. AI provides them with better information, faster insights, and recommendations that augment their expertise. We invest in our people's ability to work alongside AI, and we measure success by the quality of human-AI decisions, not by the sophistication of our models."

Note the careful framing: informed, not dictated. This is not an accident. The distinction between augmentation and automation is critical for managing fear and preserving the sense of professional agency that employees need to embrace the change.

Step 4: Communicate the Vision

The vision must be communicated repeatedly, through multiple channels, and — critically — in language appropriate for each audience. We will develop communication strategies in detail in Section 35.6. For now, the key principle: a vision that lives in a strategy document but not in daily conversation is a vision that does not exist.

Step 5: Empower Broad-Based Action

This step requires removing barriers to adoption — the structural and systemic obstacles that prevent willing employees from embracing the change. At Athena, this meant:

  • Technical barriers. Integrating the demand forecasting model into the ordering system so managers did not have to toggle between applications.
  • Policy barriers. Revising the override policy so that managers could still override the model but were asked to document the reason — transforming override from a default to a conscious choice.
  • Skill barriers. Providing the training required to interpret model outputs.
  • Incentive barriers. Adjusting compensation formulas to reward model-informed decision-making.

Step 6: Generate Short-Term Wins

Long-term AI transformation takes years. Without visible, early wins, momentum dies and skeptics gain influence. Ravi's team deliberately engineered early wins:

  • Week 4: Identified three product categories where the model's recommendations had been followed and resulted in measurably better outcomes (reduced stockouts, lower waste). Shared these results company-wide.
  • Week 8: A regional manager in Dallas — one of the early adopters — reported that the model caught a demand spike for portable fans during an unexpected heat wave two days before she would have noticed it herself. She credited the model in a team meeting. Ravi asked her to share the story at the monthly all-hands.
  • Week 12: Published the first monthly "accuracy scorecard" showing that regions using the model had 14 percent fewer stockouts than regions overriding it.

Try It: Think about an AI initiative at your organization (or one you have studied). Identify three potential "quick wins" that could be demonstrated within the first 60 days of deployment. For each, describe: (a) the metric that would improve, (b) the audience that would find the improvement compelling, and (c) the communication channel you would use to share it.

Step 7: Consolidate Gains and Produce More Change

Early wins create credibility for expanding the AI initiative. At Athena, the demand forecasting success provided the political capital to launch the next wave of AI projects — NK's personalization engine for marketing, the RAG-based customer service tool from Chapter 21, and the inventory optimization system that combined demand forecasting with supply chain data.

Step 8: Anchor New Approaches in the Culture

The final step — and the one most often skipped — is embedding AI into the organization's identity and operating norms. This means AI is no longer a "project" or an "initiative" — it is simply how we work. We will return to this step in Section 35.12.


35.4 Resistance Patterns Specific to AI

All organizational change generates resistance. AI generates specific types of resistance that leaders must recognize and address. Through Athena's experience and broader research, five patterns emerge.

Pattern 1: Fear of Job Loss

The most visceral and widely discussed form of AI resistance. Employees hear "AI" and think "automation" and think "I'm being replaced."

This fear is not irrational. As we will examine in Chapter 38, AI will significantly reshape job markets. But in most current enterprise deployments, AI augments rather than replaces workers — and the fear of replacement is usually disproportionate to the actual risk.

How to address it:

  • Be honest about which roles will change and which will not. Vague reassurances ("AI won't replace anyone") erode trust when employees can see that their tasks are being automated.
  • Distinguish between task automation and job elimination. A customer service representative whose routine inquiries are handled by an AI chatbot is not being replaced — their role is shifting toward complex problem-solving. But this distinction must be made concrete, with specific descriptions of what the new role looks like.
  • Provide transition pathways. If roles are being eliminated, communicate the timeline, the support available (reskilling programs, internal mobility, severance), and the new roles being created. We cover workforce planning in detail in Section 35.7.

Research Note: A 2024 World Economic Forum survey of 803 companies across 27 industries found that while 23 percent of jobs are expected to change significantly due to AI by 2027, 69 percent of those changes involve task modification rather than role elimination. Additionally, companies reported that for every role eliminated by AI, 1.4 new roles were created — though these new roles typically required different skills. The net employment effect of AI, at the organizational level, is more nuanced than the "robots are coming for your job" narrative suggests.

Pattern 2: "The Algorithm Is Wrong"

This resistance pattern manifests as persistent distrust of AI outputs, often grounded in specific examples where the model produced a questionable recommendation.

Athena's regional managers who cited the Phoenix winter coat recommendation and the school calendar issue were exhibiting this pattern. They seized on specific failures — real or perceived — as evidence that the entire system was unreliable. This is a form of availability bias: memorable failures loom larger than unmemorable successes.

How to address it:

  • Acknowledge that the model will be wrong sometimes. Perfection is not the standard; improvement over the status quo is.
  • Show the comparison data. Athena's accuracy scorecards did this effectively: by comparing model accuracy to manager accuracy across hundreds of decisions, the data showed that while the model was wrong 18 percent of the time, managers were wrong 29 percent of the time.
  • Fix the specific issues. The Phoenix and school calendar problems were legitimate data gaps. Ravi's team added local climate data and school district calendars to the model's feature set — and publicly credited the managers who identified the issues. This transformed critics into collaborators.
  • Provide explainability. Chapter 26's lessons apply directly here: managers who can see why the model makes a recommendation can evaluate it intelligently rather than either blindly trusting or blindly rejecting it.

Pattern 3: Data Scientist vs. Domain Expert Tension

This is among the most destructive resistance patterns because it fractures the teams that need to collaborate. Data scientists build models based on patterns in data. Domain experts bring years of contextual knowledge that data alone does not capture. When these perspectives clash — and they will — the result is often mutual disdain.

Data scientists dismiss domain experts as "not understanding the math." Domain experts dismiss data scientists as "not understanding the business." Both are partially right and entirely counterproductive.

How to address it:

  • Create structured collaboration points. At Athena, Ravi instituted "model review sessions" where data scientists presented their models' logic and regional managers provided domain feedback. The sessions had a specific format: the data scientist explained the model's top five features and their weights, and the manager identified real-world factors the model might be missing.
  • Use language intentionally. Ravi banned the phrase "the model says" in cross-functional meetings. The replacement was "the model suggests, based on [specific factors]." The shift from declarative to suggestive language reduced defensiveness and opened dialogue.
  • Celebrate joint wins. When a manager's domain insight improved a model's accuracy, both the manager and the data scientist were recognized. When a model's recommendation prevented a costly mistake, the manager who followed the recommendation was credited alongside the team that built the model.

Pattern 4: "We've Always Done It This Way"

Inertia resistance — the preference for familiar processes simply because they are familiar. This pattern is not about AI specifically; it appears in any change initiative. But AI amplifies it because AI changes not just what tool employees use but how they think about their work.

How to address it:

  • Demonstrate the cost of the status quo. Abstract arguments about "innovation" do not overcome inertia. Concrete data about the cost of current methods — $11.2 million in annual inventory waste, for instance — creates the motivation to change.
  • Provide a gradual transition. Rather than flipping a switch from "no AI" to "full AI," create intermediate states where employees use AI recommendations as one input alongside their existing judgment. Over time, as they see the model's value, they voluntarily shift their weighting.
  • Respect experience. The sentence "We've always done it this way" is often a proxy for "My twenty years of experience have value, and I need to know that the organization still respects that." Acknowledging the expertise while presenting AI as a tool that enhances it — rather than one that replaces it — addresses the underlying anxiety.

Pattern 5: The Trust Deficit

The deepest and most pervasive pattern. Trust in AI is not binary (trust vs. distrust) but multidimensional. Employees must trust:

  • The model's accuracy — that it produces reliable outputs.
  • The model's fairness — that it does not systematically disadvantage certain groups (a concern Athena learned viscerally in Chapter 25).
  • The organization's intent — that AI is being deployed to improve the work, not to surveil, control, or eliminate workers.
  • The change process — that leadership is being honest about the implications and responsive to feedback.

Each trust dimension requires a different response. Technical trust requires transparency and track records. Fairness trust requires auditing and governance (Chapter 27). Organizational trust requires consistent, honest communication. Process trust requires genuine two-way dialogue.

Business Insight: Trust is built slowly and destroyed quickly. A single incident of AI producing a biased or harmful outcome — as Athena experienced with the resume screening tool in Chapter 25 — can set back organizational trust by months or years. This is why governance and change management are not separate disciplines; they are deeply interconnected. The governance structures from Chapters 27-30 directly support the change management goals of this chapter.


35.5 The "Last Mile" Problem

In telecommunications, the "last mile" refers to the final stretch of network that connects the infrastructure to the end user's home. It is typically the most expensive, technically challenging, and operationally frustrating segment of the entire network. AI deployment has its own last mile problem, and it is similarly vexing.

Definition: The "last mile" problem in AI refers to the gap between a technically deployed model and a model that is actually used by its intended users to make better decisions. It encompasses the adoption, integration, and behavioral changes required to translate technical performance into business value.

Consider the journey of an AI model at Athena:

The last mile is often nobody's explicit responsibility. Data scientists build models and hand them off. Engineers deploy them and move on. Product managers may track feature adoption, but change management often falls between organizational cracks.

Why Technically Successful Projects Fail

A 2024 Gartner study found that approximately 85 percent of AI projects that reach production fail to deliver their expected business value. The technical success rate — models that perform at or above target metrics — is much higher, around 60 to 70 percent. The gap between technical success and business value is the last mile.

Common last mile failure modes include:

The Dashboard Nobody Opens. The model is deployed, a dashboard is built, and the link is emailed to stakeholders. Usage data shows 40 percent open the dashboard in the first week, 15 percent use it in the second week, and 3 percent use it by week eight. The model works perfectly. No one looks at it.

The Recommendation Ignored. The model produces recommendations that are technically sound but operationally impractical. A pricing model recommends adjusting prices 14 times per day — but the POS system only supports three price changes per week. A staffing model recommends 15-minute scheduling granularity — but union contracts require 4-hour minimum shifts. The model optimizes for the wrong constraints because no one asked the frontline workers what constraints matter.

The Parallel Process. Employees adopt the AI tool but maintain their old process in parallel, "just in case." They spend time on both, trust neither, and the AI initiative adds work rather than reducing it. This is particularly common in regulated industries where employees feel personally liable for AI-informed decisions.

The Expert Override. Senior employees with strong domain expertise systematically override AI recommendations, and their organizational status insulates them from accountability for doing so. Junior employees follow the senior employees' lead. The model becomes the tool that new hires use until they "learn enough to know better."

Closing the Last Mile

Closing the last mile requires treating adoption as a design problem, not an afterthought.

Co-design with users. Involve the intended users — not just their managers — in designing the AI-powered workflow from the beginning. At Athena, Ravi's team rebuilt the demand forecasting interface based on input from regional managers. Managers wanted to see the model's top three recommended order quantities with confidence intervals, alongside their own historical ordering patterns and a comparison of outcomes. This "decision cockpit" replaced the original interface, which simply displayed a single recommended number.

Reduce friction ruthlessly. Every click, every screen change, every manual step between the AI recommendation and the action it supports is a point of adoption failure. The demand model's integration into the ordering system — eliminating the need for managers to toggle between applications — was the single change that produced the largest adoption increase.
